Large language models can write poetry, summarize legal briefs, and generate working code. But ask one to update its beliefs about a user across a series of interactions -- the kind of probabilistic reasoning that underpins everything from medical diagnosis to personalized recommendation -- and it stumbles. A team of researchers from Google Research, MIT, and NYU has published a method that closes that gap. Their paper, Bayesian Teaching Enables Probabilistic Reasoning in Large Language Models, appeared in Nature Communications in early 2026 and lays out a surprisingly elegant solution: teach LLMs to imitate an optimal Bayesian reasoner rather than training them on correct answers directly.
The Problem: LLMs Do Not Update Beliefs Well
Bayesian inference is the gold standard for rational belief updating. When new evidence arrives, a Bayesian agent revises its estimate of the world in a mathematically optimal way, weighting prior beliefs against the likelihood of the new observation. Humans approximate this process imperfectly but consistently. LLMs, it turns out, barely do it at all.
The research team -- Linlu Qiu, Fei Sha, Kelsey Allen, Yoon Kim, Tal Linzen, and Sjoerd van Steenkiste -- designed a multi-round flight recommendation task to measure the problem. In each round, a simulated user was presented with three flight options defined by departure time, duration, number of stops, and cost. The user chose one flight based on hidden preference weights. The LLM assistant then had to predict which flight the user would pick in the next round, using the accumulating history of choices.
Without targeted training, the models performed poorly. They defaulted to surface-level heuristics -- assuming every user wanted the cheapest option, for instance -- instead of refining a probabilistic model of user preferences over successive rounds. Critically, their predictions showed limited improvement after the first interaction, suggesting they were not meaningfully updating their internal estimates at all.
The Solution: Bayesian Teaching
The core insight of the paper is a training strategy the authors call Bayesian teaching. Rather than fine-tuning an LLM on the correct final answers -- which flight the user actually chose, a method they term oracle teaching -- the researchers fine-tune it on the intermediate probabilistic predictions of a symbolic Bayesian model that implements optimal belief updating.
The procedure works as follows. First, the team builds a Bayesian Assistant: a symbolic system that maintains an explicit probability distribution over possible user preference profiles and updates it via Bayes rule after each observed choice. This assistant does not guess which flight the user will pick; it outputs a full probability distribution over the options. Second, the team generates thousands of synthetic multi-round interaction transcripts between simulated users and this Bayesian Assistant. Third, the LLM is fine-tuned on these transcripts, learning to mimic the Bayesian Assistant rather than just predicting ground-truth outcomes.
This is a form of model distillation -- a neural network learning to approximate the behavior of a symbolic system -- but applied specifically to the skill of sequential belief updating rather than to factual knowledge.
Why Bayesian Teaching Beats Oracle Teaching
The key finding is counterintuitive: teaching a model to reproduce probabilistic best guesses is more effective than teaching it the right answers. Models trained with Bayesian teaching agreed with the optimal Bayesian strategy roughly 80 percent of the time, significantly outperforming both untrained baselines and oracle-taught models. More importantly, Bayesian-taught models showed stronger improvement across multiple interaction rounds, demonstrating that they had internalized the sequential updating logic rather than memorizing patterns from the training distribution.
Oracle teaching, by contrast, produced models that learned to predict correct outcomes in familiar settings but failed to generalize the underlying reasoning process. The distinction matters: correct answers tell a model what to think, while Bayesian teaching shows it how to think.
Generalization to New Domains
Perhaps the most striking result is the degree to which Bayesian-taught models transfer their reasoning ability to entirely new domains. Models trained exclusively on synthetic flight recommendation data successfully applied their probabilistic updating skills to hotel recommendation tasks and real-world web shopping scenarios -- domains with different feature spaces, different user behavior patterns, and different decision structures.
This cross-domain generalization suggests that the models are not simply memorizing the statistics of the flight task. They appear to be acquiring a more abstract capacity for sequential belief revision that persists across contexts. The researchers conclude that LLMs can effectively learn reasoning skills from examples and generalize those skills to new domains, a finding with broad implications for how the field approaches training for complex cognitive tasks.
Why It Matters
The practical applications extend well beyond flight booking. Any system that must infer user intent over multiple interactions -- adaptive tutoring platforms, diagnostic chatbots, personalized content feeds, customer service agents -- faces the same fundamental challenge of sequential belief updating. If Bayesian teaching can reliably instill this capacity in general-purpose language models, it could meaningfully improve the quality of AI-driven personalization across industries.
At a theoretical level, the work also challenges the assumption that probabilistic reasoning must be explicitly engineered into AI systems through structured architectures or symbolic modules. The results suggest that standard transformer-based LLMs have the latent capacity for Bayesian-style reasoning; they simply need the right training signal to unlock it.
